Bluetooth audio stutters only on first connection after reboot

When connecting to my bluetooth speaker, the audio is choppy and unlistenable, but only for the first connection after reboot. I.e. if I

bluetoothctl disconnect

and

bluetoothctl connect

again then the sound is fine. Both pulse and pipewire behave the same. I don't see anything off in the logs when the audio is choppy.

Any ideas how I might fix this? Thanks.
